Self-Distillation Enables Continual Learning
Paper · 2026 · Idan Shenfeld, Mehul Damani, Jonas Hubotter et al.
Summary
Foundation models usually stop learning after deployment. Fine-tuning them on new data with supervised fine-tuning (SFT) tends to erase earlier abilities, because SFT trains on a fixed external data distribution, which makes it off-policy. On-policy reinforcement learning forgets less, but it requires a reward function, and in many settings only expert demonstrations exist.
The authors propose Self-Distillation Fine-Tuning (SDFT), which gets on-policy training signals from demonstrations alone. One model plays two roles:
- Teacher: the model receives the query plus an expert example through a short prompt, so it relies on in-context learning.
- Student: the model sees only the query.
The student generates its own answers and is trained to reduce the reverse KL divergence to the teacher's token distribution. The teacher's weights follow the student as an exponential moving average.
Using Qwen2.5-7B-Instruct, SDFT was tested on skill learning (Science Q&A, tool use, medical) and on knowledge acquisition (facts about 2025 events). It reached higher new-task accuracy than SFT and kept general benchmark scores close to the base model. Learning three skills in sequence caused no regression. This makes continual learning from demonstrations practical without reward engineering.
Key points
- Setup: Qwen2.5-7B-Instruct was the base model. SDFT was compared with SFT, DFT and "SFT + re-invoke", and with continued pretraining (CPT) for knowledge acquisition.
- Science Q&A: accuracy rose from 32.1 (base) to 70.2 with SDFT, versus 66.2 with SFT. The average score on prior tasks stayed at 64.5, against 65.5 for the base model and 53.4 after SFT.
- Tool use and medical: SDFT scored 70.6 on tool use (SFT 63.2) and 40.2 on medical (SFT 35.5). Its prior-task average was 65.4 in both cases, while SFT dropped it to 56.0 and 60.2.
- Prior-capability suite: HellaSwag, HumanEval, IFEval, MMLU, TruthfulQA and Winogrande. SFT caused the sharpest drop on IFEval, falling from 74.3 to 35.3 in the Science Q&A run.
- Knowledge-acquisition data: a new corpus of Wikipedia articles on 2025 natural disasters, such as the Myanmar earthquake and Hurricane Melissa. GPT-5 generated question–answer pairs from the articles, and GPT-5-mini graded the answers. Code and datasets are released.
