Unlocking Exploration in RLVR: Uncertainty-aware Advantage Shaping for Deeper Reasoning

Paper · 2026 · Can Xie, Ruotong Pan, Xiangyu Wu et al.

Summary

Standard RLVR algorithms such as GRPO give every token in a sampled response the same advantage. They cannot tell pivotal reasoning decisions from routine ones, so the policy settles too early on a few safe trajectories and suffers entropy collapse. The authors, from Kuaishou Technology, propose UCAS (UnCertainty-aware Advantage Shaping). It needs no extra reward or critic model and instead reshapes advantages using the policy's own uncertainty, in two stages:

  • Response level: a logit-space self-confidence score scales the group-normalized advantage. Correct answers produced with low confidence get larger rewards, and wrong answers produced with high confidence get harsher penalties.
  • Token level: an asymmetric penalty based on the chosen token's raw logit discourages local overconfidence. Positive trajectories are shielded from negative token updates.

Built on top of DAPO and tested on five math reasoning benchmarks at 1.5B and 7B scale, UCAS beats strong RLVR baselines. It also yields longer reasoning chains, more diverse solutions and an entropy curve that recovers after an initial drop. This makes internal uncertainty a cheap, fine-grained substitute for costly process reward models.

Key points

  • Confidence signals:
    • Sequence confidence averages a per-token score, defined as log-sum-exp of the logits minus their mean.
    • This score equals KL(uniform ‖ policy) plus log|V|, which avoids numerical instability in probability space.
    • Token certainty is the raw pre-softmax logit of the sampled token.
  • Ablation with Qwen2.5-Math-7B:
    • DAPO alone scores 30.5 and 81.8 on the two reported benchmarks.
    • Adding only response-level confidence gives 40.0 / 85.0.
    • Adding only token-level certainty gives 36.7 / 84.6.
    • Full UCAS reaches 43.3 / 85.6.
  • 1.5B model: UCAS improves DAPO from 16.7 / 77.6 to 23.3 / 80.6.
  • Sensitivity on Math-500: the best setting is α = 0.2 with β = 0.01 (80.4). Larger β (0.05–0.1) or α = 0.4 lowers accuracy to about 78.4–78.8.
  • Limitations and code: experiments cover only 1.5B and 7B models. Code is available at github.com/xvolcano02/UCAS.
