Rethinking Entropy Interventions in RLVR: An Entropy Change Perspective
Paper · 2026 · Zhezheng Hao, Hong Wang, Haoyang Liu et al.
Summary
Policy optimization in RLVR often suffers from entropy collapse. Policy entropy falls quickly, rollouts become uniform, and group-relative advantages (as in GRPO) stop separating good responses from bad ones. Existing fixes such as Clip-Higher, Positive-Reweighting and Entropy-Aware Advantage are largely heuristic, and it is unclear why they work.
The authors derive an approximate formula for how a single token's entropy shifts after one gradient update. It depends on four factors: the clipping indicator, the advantage, the token's probability, and the conditional entropy of the state. This formula explains each prior method as acting on only one or two factors, often for a narrow subset of tokens, which limits their effect and can sometimes speed up collapse.
Building on this, they propose STEER. It converts the predicted per-token entropy change into adaptive weights, shrinking the contribution of tokens expected to change entropy too much. Across six math and three coding benchmarks, STEER keeps entropy stable and beats ten baselines. This makes it a principled, plug-in tool for exploration-preserving RL fine-tuning of LLMs.
Key points
- Accuracy of the estimate. The token-level estimate Ω(s) tracks real entropy change far better than the earlier covariance-based estimate (Cov). For example, on Math-1.5B the MSE drops from 5.37 to about 5e−4, with clearly higher PCC and SRCC.
- Math reasoning results. On math tasks, STEER's average score is 2.2 points above the next-best method (OPO) and 2.9 above Clip-Cov. It also leads on Qwen2.5-14B and on pass@256/512/1024 for AIME24/25.
- Coding results. On three Qwen2.5-coder models, STEER beats GRPO by at least 1% on every test set.
- Near-unclipped training. In a setting with almost no clipping (ε_high = 5, ε_low = 0.99), STEER reaches a 48.5 average versus 44.9 for GRPO, while the other methods collapse, blow up, or fail to control entropy.
- Generalization. The gains carry over across model scales (1.5B/7B/14B), model families (Qwen, Llama-3.2-3B-Instruct, Mistral-7B-v0.3), and RL algorithms (GRPO, RLOO, OPO).
