LoopTool: Closing the Data–Training Loop for Robust LLM Tool Calls

Paper · 2026 · Kangning Zhang, Weiwen Liu, Wenxiang Jiao et al.

Summary

Synthetic data pipelines for training tool-calling LLMs are usually static. Data are generated once, without regard to what the model already handles or still gets wrong, and noisy labels from cheaper open-source generators stay in the set. LoopTool addresses this by turning data creation and training into one iterative cycle. It first builds a seed corpus: APIs are synthesized with a Hierarchical Dual-Tree method, and four simulated agents produce dialogs that are then filtered by rules and by an LLM. A first GRPO training round follows. Each later round has three steps:

  • GCP probes the trained model to find where it succeeds and fails.
  • JGLV uses Qwen3-32B as a judge to repair faulty reference labels.
  • EDDE turns confirmed failures into new, varied hard examples.

The whole loop runs on open-source models and needs no paid APIs. The resulting LoopTool-8B outperforms Qwen3-32B, the model that generated and judged its data. It reaches state-of-the-art results for its size on BFCL-v3 and ACEBench. This suggests that self-correcting data loops can cheaply strengthen tool use in smaller models.

Key points

  • Qwen3-32B serves as both data generator and judge. GRPO with simple binary rewards drives training. Code is available at github.com/DeepExperience/LoopTool.

  • Ablations show each module matters:

    • Removing JGLV clearly lowers accuracy, because label errors persist and spread through EDDE variants.
    • Simply retraining on the original failed seeds helps less than EDDE's generated variants.
  • Scaling experiments on Qwen3 backbones from 0.6B to 8B show larger second-iteration gains for bigger models on BFCL-v3: +0.70 points at 0.6B versus +1.80 at 8B.

  • Compared with vanilla Qwen3-8B on non-tool benchmarks, LoopTool-8B improves:

    • IFEval: +1.40
    • LiveCodeBench: +3.84
    • Math-500: +1.20
    • AIME24: 60.00 → 70.00
    • AIME25: 56.67 → 66.67

    MMLU-redux stays roughly unchanged (87.72 vs. 87.37).

  • Limitations: the loop runs offline, with each round waiting for training to finish. Evaluation is mostly limited to function-calling benchmarks.
