rStar2-Agent: Agentic Reasoning Technical Report

Paper · 2025 · Ning Shang, Yifei Liu, Yi Zhu et al.

Summary

Long chain-of-thought reasoning helps LLMs on hard math, but models that rely only on internal self-checking often miss subtle mistakes. rStar2-Agent addresses this by training a 14B model to solve problems alongside a Python interpreter. The model writes code, reads the execution output, and revises its steps, and it learns this through agentic reinforcement learning. Three components make the approach practical:

  • Infrastructure. An isolated, high-throughput code sandbox is paired with a rollout scheduler that distributes requests according to free KV cache on each GPU.
  • Algorithm. GRPO-RoC oversamples rollouts, keeps only the cleanest successful traces, and subsamples failures uniformly. This suppresses noise from buggy tool calls without adding error penalties to the reward.
  • Training recipe. A non-reasoning SFT stage teaches instruction following and tool formatting. Several RL stages follow, with rising difficulty and modest length caps (8K→12K).

After 510 RL steps on 64 MI300X GPUs, taking roughly a week, rStar2-Agent-14B matches or exceeds DeepSeek-R1 (671B) on competition math while producing shorter answers. This suggests that tool-grounded RL can partly replace sheer model scale.

Key points

  • Pass@1 scores are 80.6% on AIME24, 69.8% on AIME25 and 52.7% on HMMT25. On AIME24 it surpasses o3-mini (medium), DeepSeek-R1 and Claude-Opus-4.0 (Think).
  • The code environment handles about 45K concurrent tool calls and returns execution feedback in roughly 0.3 s on average.
  • RL was trained on math only, yet the model generalizes:
    • it outperforms DeepSeek-V3 on GPQA-Diamond,
    • it performs well on BFCL v3,
    • it is competitive on IFEval and Arena-Hard.
  • An entropy analysis finds two patterns. The model keeps the familiar "forking" tokens for self-reflection, and it also develops new high-entropy reflection tokens after tool responses. The generated code tokens themselves stay low-entropy.
  • Code, data and training recipes are released at github.com/microsoft/rStar.
