Lightning OPD: Efficient Post-Training for Large Reasoning Models with Offline On-Policy Distillation
Paper · 2026 · Yecheng Wu, Song Han and Han Cai
Summary
On-policy distillation (OPD) trains a student LLM to imitate a stronger teacher's per-token distribution on the student's own samples. It typically beats RL-style post-training in stability and cost. The drawback is that a teacher model must keep running on separate GPUs for the whole training job. The authors ask whether teacher scores can be computed once in advance. Their method, Lightning OPD, samples responses from the SFT-initialized student, has the teacher score those fixed responses a single time, and then trains entirely offline.
A naive offline version underperforms. The authors trace this to a hidden requirement they call teacher consistency: the model that produced the SFT data must also be the OPD teacher. Breaking this rule biases the gradients, in both online and offline OPD. When the rule holds, they prove that the offline objective and standard OPD share an identical optimum, that their gradients differ by no more than a bounded amount, and that the offline version inherently regularizes against drift.
On math and code benchmarks with Qwen3 students, Lightning OPD matches standard OPD while cutting compute about fourfold. This makes strong post-training practical on modest academic hardware.
Key points
- Cost and accuracy at 8B: A Qwen3-8B-Base student with a Qwen3-32B teacher reaches 69.9% on AIME 2024. This takes about 30 GPU hours versus roughly 120 for standard OPD, a 4.0× gain.
- Cost at 4B: A Qwen3-4B-Base student with a Qwen3-8B teacher needs about 20 GPU hours instead of 72, a 3.6× speedup.
- Mixture-of-Experts scale: Qwen3-30B-A3B-Base, taught by Qwen3-30B-A3B-Thinking-2507, was trained on one 8×H100 node, where standard OPD runs out of memory. Compared with the SFT starting point:
- AIME 2024 rose from 66.8% to 71.0%.
- LiveCodeBench v5 rose from 39.4% to 60.8%.
- Teacher-consistency ablation: QwQ-32B was swapped in as either the SFT or the OPD teacher. Matched teachers always scored best. At 8B, a mismatch cost Lightning OPD 6.8 AIME points, compared with 3.7 for standard OPD. The offline variant suffers more because its fixed rollouts also come from the flawed SFT model.
- Code availability: The code is published at github.com/jet-ai-projects/Lightning-OPD.
