RedStar: Does Scaling Long-CoT Data Unlock Better Slow-Reasoning Systems?
Paper · 2025 · Haotian Xu, Xing Wu, Weinong Wang et al.
Summary
The paper asks whether enlarging the pool of long chain-of-thought (Long-CoT) training data yields stronger "slow-thinking" reasoners, and which factors matter most. The authors build Long-CoT data mainly from math problems (Metamath-qwen2-math), plus code (TACO) and geometry (GeoQA). A classifier scores problem difficulty, QwQ generates long solutions for the harder ones, and the outputs are checked for correct answers, language, repetition and length to form positive and negative examples. They vary the data volume up to 1000k samples, the base model size and the degree of math specialization. Supervised tuning is followed by DPO and PPO, and the recipe is extended to multimodal geometry. The resulting RedStar models show that a few thousand well-chosen, moderately hard examples are enough to trigger Long-CoT behaviour. Larger and math-specialized bases gain the most, and general abilities are largely preserved. This matters because it suggests strong reasoning can be obtained cheaply, and the data and weights are public.
Key points
- Sources: Metamath-qwen2-math has about 900k problems with prompts from MetaMathQA and NuminaMath-CoT. TACO contributes 25,443 coding problems and GeoQA contributes 3,499 geometry prompts.
- A difficulty scorer based on Qwen2.5-7B-Instruct was trained on MATH and Omni-MATH. Only problems rated level 7 or higher were kept for QwQ sampling.
- A compact set of 1.3k prompts and 4k responses, used to tune Qwen-32B-Instruct, already gives large gains. 14B and 32B models outperform 7B models.
- RedStar-code-math raises MATH-Hard accuracy from 66.2% to 81.6% and solves 46.7% of AIME problems using 21k mixed code-math samples. Both DPO and PPO bring further improvements.
- RedStar-Geo is competitive on GeoQA and MathVista-GEO and beats QvQ-Preview. Data and models are released at huggingface.co/RedStar-Reasoning.
