Scaling of Search and Learning: A Roadmap to Reproduce o1 from Reinforcement Learning Perspective
Paper · 2024 · Zhiyuan Zeng, Qinyuan Cheng, Zhangyue Yin et al.
Summary
This paper is a survey and position piece on how one might rebuild OpenAI's o1 reasoning model. The authors argue that reinforcement learning, not knowledge distillation, is the right path, because distilled students are capped by their teacher's ability. They break the problem into four parts:
- Policy initialization: pre-training plus prompting or SFT to give the model human-like reasoning habits.
- Reward design: producing dense guidance signals.
- Search: spending more compute to find better solutions during both training and inference.
- Learning: updating the policy from the data that search produces.
The paper offers no new model or dataset. Instead, it organizes a large body of prior work under this framework and shows that current open-source o1 replication efforts fit as pieces or variants of it. The authors frame o1's progress as a joint scaling of training compute (RL) and test-time compute (search), echoing Sutton's "bitter lesson." The roadmap is useful as a map for researchers, and it closes by naming open challenges: reward models for general domains, multimodal reasoning, and world models.
Key points
- Policy initialization aims to instill behaviours such as goal clarification, task decomposition, proposing alternatives, self-evaluation and self-correction. It relies on pre-training followed by prompt engineering or SFT.
- Rewards can be outcome-level or process-level.
- Reward shaping (Ng et al., 1999) turns sparse outcome rewards into dense process rewards.
- Where no environment reward exists, a model can be learned from preference data (Bradley-Terry) or from expert data via inverse RL.
- This line of work could eventually grow into a world model.
- Search can be guided by internal or external signals and includes Best-of-N, beam search, MCTS and sequential revisions. Pushing test-time search further may backfire (inverse scaling) because of distribution shift.
- Learning comes in two families:
- Policy-gradient methods (REINFORCE, PPO, DPO) exploit both good and bad solutions.
- Behavior cloning is simpler and lighter on memory.
- AlphaGo Zero, which pairs MCTS with behavior cloning, is the reference example.
- Open-source projects are each mapped onto the framework:
- Open-Reasoner: MCTS at test time only, with a Math-Shepherd-style reward model.
- Slow Thinking with LLMs: DPO training; Part 2 distills from QwQ and Deepseek-R1.
- Marco-o1: MCTS combined with per-step self-reflection.
- o1-coder: generated test cases provide the outcome reward, plus a PRM.
