Agent Q: Advanced Reasoning and Learning for Autonomous AI Agents
Paper · 2024 · Pranav Putta, Edmund Mills, Naman Garg et al.
Summary
LLMs that perform well on static text tasks often fail as autonomous web agents. Long multi-step interactions cause errors to accumulate. Fine-tuning only on expert demonstrations gives the model little exploratory experience. Agent Q addresses this by pairing search with learning. A Monte Carlo Tree Search (MCTS) procedure, using UCB1 for action selection, explores web pages. At each step, the model also critiques its own candidate actions, which provides intermediate rewards when environment feedback is sparse. The resulting search trees become training data. Sibling branches are ranked by a blend of MCTS Q-values and critic scores, and these pairs train the policy with an off-policy version of DPO, so both successes and failures contribute. The method was tested on the simulated WebShop store and on live OpenTable restaurant booking, with LLaMA-3-70B-Instruct as the base policy. On OpenTable, one day of autonomous data collection raised success from 18.6% to 81.7%, and adding search at inference reached 95.4%. This suggests agents can improve substantially with little human supervision.
Key points
- On WebShop, Agent Q beats behavior cloning and RFT baselines, and with online search it exceeds average human performance.
- On OpenTable, one RFT round on 600 successful trajectories lifted LLaMA-3-70B-Instruct to 67.2%, already above GPT-4o zero-shot at 62.6%. xLAM-v0.1-r scored 0.0% on this task.
- Ablations on OpenTable:
- Trajectory-level DPO with outcome rewards only: 71.8%.
- MCTS using outcome-only Q-values: 75.2%.
- Full Agent Q with process-level AI feedback: 81.7%.
- RFT model with MCTS: 84.3%.
- Agent Q with MCTS: 95.4%.
- The agent acts through a DOM-based action space with commands such as CLICK, TYPE, GOTO, SCROLL and ASK USER HELP.
- Limitations noted by the authors:
- The critic stays frozen during training.
- There is a large gap between zero-shot and search-assisted performance.
- Irreversible mistakes during live exploration raise safety risks, for example in payments or email.
