World Model on Million-Length Video And Language With Blockwise RingAttention

Paper · 2024 · Hao Liu, Wilson Yan, Matei Zaharia et al.

Summary

Most sequence models handle only short inputs, so they struggle with long documents and long videos. Training at million-token scale is also hard because of memory and compute costs and because long-context data is scarce. The authors start from Llama2 7B and extend its context window step by step to 1M tokens using Books3 texts. They rely on Blockwise RingAttention fused with FlashAttention, written in Pallas, which spreads very long sequences across TPU devices without approximation. To build long-context chat data, a short-context model writes question-answer pairs for book chunks. In a second stage, the model is trained jointly on text, images, and video, using VQGAN tokens, masked sequence packing, and loss balancing. The resulting Large World Model (LWM) family performs competitively with GPT-4 and Gemini Pro on needle retrieval while supporting a much longer context. It can also answer questions about hour-scale videos and generate images and videos. Because the code and models are open, the work offers a reproducible recipe for million-token multimodal modelling.

Key points

  • Progressive context extension. Context grows over five stages (32K, 128K, 256K, 512K, 1M) on filtered Books3 from The Pile. RoPE θ is scaled up with each stage, from 1M to 50M. Training ran on TPU v4-512 and v4-1024.
  • Synthetic long-context QA. Books are cut into 1,000-token chunks, and a model generates a QA pair for each chunk. The chunks are then concatenated into long sequences. This data is mixed with UltraChat at roughly a 7:3 ratio, with the two sources packed separately.
  • Multimodal tokenization. Each video frame becomes 256 VQGAN tokens, and text uses a BPE tokenizer. Special delimiters such as <vision>, <eof>, and <eov> mark the boundaries.
  • Short-context performance is preserved. Extended models stay close to the Llama-2 7B baseline on short benchmarks. For example, MMLU is 0.39 for the baseline and 0.35–0.41 for LWM-Text variants.
  • Released models. The open models are LWM-Text, LWM-Text-Chat, LWM, and LWM-Chat, all 7B with up to 1M-token context.
