Can Long-Context Language Models Subsume Retrieval, RAG, SQL, and More?
Paper · 2024 · Jinhyuk Lee, Anthony Chen, Zhuyun Dai et al.
Summary
Long-context language models (LCLMs) can now read inputs of up to a million tokens. This raises the question of whether they could replace separate tools such as retrievers, RAG pipelines and SQL engines. Existing long-context tests are either synthetic, like needle-in-a-haystack, or fixed in length, so they cannot answer this question well. The Google DeepMind authors therefore built LOFT, a benchmark of real tasks whose context size can be scaled automatically. For each dataset, gold items are mixed with randomly sampled filler material to form one shared corpus, and smaller corpora are nested inside larger ones. They also propose Corpus-in-Context (CiC) prompting, which places the whole corpus directly in the prompt together with instructions and few-shot examples. Gemini 1.5 Pro, GPT-4o and Claude 3 Opus were compared with specialized systems. Without any task-specific training, the LCLMs roughly matched dedicated retrievers. However, they struggled with compositional, SQL-style reasoning, and their scores depended strongly on prompt design. LOFT gives a scalable way to track whether LCLMs can absorb tool-based pipelines.
Key points
- Benchmark scope: LOFT has 6 task types (text, visual and audio retrieval, RAG, SQL, many-shot ICL) built from 35 datasets across 4 modalities. Sources include BEIR datasets, HotPotQA, MuSiQue, QUEST, Flickr30k, MS COCO, MSR-VTT, FLEURS, Spider, SParC, BBH and LongICLBench.
- Context sizes and sampling: LOFT comes in 32k, 128k and 1M token versions, and the authors say it can be extended toward billions of tokens. Each dataset has up to 100 test, 5 few-shot and 10 dev queries. Corpora fill about 0.9N of the context window to leave room for instructions and tokenizer differences.
- Retrieval results: At 128k tokens, LCLMs rival the Gecko text retriever, and Gemini 1.5 Pro outperforms CLIP on visual retrieval. Multi-hop compositional and SQL-like tasks remain clearly weaker.
- Prompt ablations: Removing document content and keeping only titles hurts scores badly, which suggests the models rely on the provided context rather than memorized knowledge. Dropping the repeated document IDs lowers results by about 5%. Raising the number of few-shot examples from zero to 5 improves retrieval from 0.76 to 0.81.
- Cost and latency: Running the full 128k test set (about 448M input tokens) cost about $1,568 with Gemini 1.5 Pro, $2,240 with GPT-4o and $6,720 with Claude 3 Opus. Median Gemini latency was about 4 s at 32k, 12 s at 128k and 100 s at 1M tokens. The data is released at github.com/google-deepmind/loft.
