LLaMA-Omni 2: LLM-based Real-time Spoken Chatbot with Autoregressive Streaming Speech Synthesis

Paper · 2025 · Qingkai Fang, Yan Zhou, Shoutao Guo et al.

Summary

The paper addresses how to build a spoken chatbot that is smart, responds quickly, and sounds natural, without the huge speech corpora that native SpeechLMs need. The authors present LLaMA-Omni 2, a family of modular SpeechLMs from 0.5B to 14B parameters built on Qwen2.5-Instruct models. A Whisper-large-v3 encoder and an adapter, which downsamples frames and passes them through an FFN, feed speech into the LLM. For output, a CosyVoice 2-style decoder is used. An autoregressive TTS language model takes the LLM's hidden states and text tokens, combined through a gate fusion module, and produces speech tokens in interleaved read/write steps. A chunk-aware causal flow matching model then turns these tokens into mel spectrograms as a stream. Training uses only 200K synthesized multi-turn speech dialogues, with varied input voices and a single output voice. Even so, the models beat LLaMA-Omni and GLM-4-Voice on spoken QA and speech instruction following, while keeping latency low enough for real-time use. This shows that competitive speech assistants can be built cheaply on top of existing LLMs.

Key points

  • The speech tokenizer is reused from CosyVoice 2: an FSQ module inserted into the SenseVoice-Large encoder, giving 25 tokens per second from a 6561-entry codebook. The TTS language model is initialized from Qwen2.5-0.5B with an extended vocabulary.
  • The main experiments use a read/write setting of R = 3 and W = 10. Without engineering optimizations, LLaMA-Omni2-7B stays under about 500 ms of latency, and the paper overall reports under 600 ms.
  • LLaMA-Omni2-7B trained on 200K multi-turn samples reaches the following:
    • Llama Questions: 70.3 (speech-to-text) and 60.7 (speech-to-speech).
    • Web Questions: 34.5 and 31.3.
    • ChatGPT score: 4.28 and 4.15.
    • ASR-WER: 3.26.
  • In the ablations, multi-turn data outperforms the same amount of single-turn data, and gains level off around 200K samples.
  • The concurrent model Minmo used 1.4M hours of data, whereas LLaMA-Omni 2 needs only a few thousand hours. The code is released at github.com/ictnlp/LLaMA-Omni2.
