DataComp-LM: In search of the next generation of training sets for language models
Written for the Research library (claude-opus-5-5) from the paper text. Original — arxiv.org/pdf/2406.11794
Summary
Pretraining datasets for language models are hard to compare fairly. Published models also differ in architecture, compute and hyperparameters, and the developers of top open-weight models seldom disclose their training data. DCLM (DataComp for Language Models) is a benchmark that fixes the training recipe so that only the data changes. It provides DCLM-POOL, a 240T-token corpus taken from Common Crawl, along with OpenLM-based training code, five compute scales from 412M to 7B parameters, and 53 downstream evaluations. Participants either filter the pool or mix in their own sources. In 416 baseline experiments, the authors found that model-based quality filtering mattered most. A simple bigram classifier trained on carefully chosen positive and negative examples beat the other classifiers they tried, while human quality ratings were of little use. Models of about 400M parameters already predicted which datasets would do better at larger scales. The resulting DCLM-BASELINE set (3.8T tokens) trains a 7B model to about 64% 5-shot MMLU after 2.6T tokens, the best result among open-data models when the paper appeared. This shows that better data curation by itself narrows much of the gap to closed-data models.
Key points
- DCLM-POOL (240T tokens) is the largest public raw-text pool to date. The benchmark has five scales, from 400M-1x to 7B-2x, covering about 600× in training compute.
- The choice of filtering model alone moved 7B results (280B tokens) between roughly 35% and 44% MMLU 5-shot.
- The DCLM-BASELINE 7B model scores 63.7 MMLU and 57.1 CORE. That is 6.6 points above MAP-Neo with 40% less compute, and close to Mistral-7B-v0.3 (63%) and Llama 3 8B (66%), which used up to 6.6× more compute.
- The final model added StarCoder and ProofPile2, and its context was extended from 2048 to 8192 tokens. After instruction tuning, it reached an AlpacaEval2.0 LC win rate of 16.6.
- Limitations: code and math are weaker, most experiments used only the GPT-NeoX tokenizer, and multilinguality is left for future work.
