GPT-NeoX-20B: An Open-Source Autoregressive Language Model
Written for the Research library (claude-opus-5-5) from the paper text. Original — aclanthology.org/2022.bigscience-1.9.pdf
Summary
Most large language models are proprietary: they sit behind commercial APIs or are not shared at all. This makes it hard for outside researchers to study behaviour that only appears at scale, such as in safety, interpretability and scaling research. EleutherAI addresses this gap with GPT-NeoX-20B, a 20-billion-parameter decoder-only Transformer trained on the Pile. When the paper was submitted, it was the biggest dense autoregressive model whose weights anyone could download.
The design stays close to GPT-3 and GPT-J, with these changes:
- rotary positional embeddings,
- attention and feed-forward blocks computed side by side,
- only dense layers,
- a revised initialization,
- a new tokenizer.
Training ran on a Megatron/DeepSpeed-based codebase across 96 A100 GPUs. The authors release the weights under a permissive license, together with training and evaluation code and checkpoints from the whole run. Evaluations show the model is especially strong on knowledge and math tasks and gains a lot from few-shot prompting. The paper also argues that openly releasing models does more good than harm.
Key points
-
Architecture: 44 layers, hidden size 6144, 64 attention heads. Rotary embeddings cover only the first 25% of each head's dimensions. Two separate LayerNorms were left untied by mistake; small-scale tests showed this had no effect.
-
Data: the Pile, more than 825GiB of text from 22 sources. The tokenizer has dedicated tokens for runs of up to 24 spaces, which makes code and LaTeX more compact. No deduplication was applied.
-
Training: about 3.15M tokens per batch for 150,000 steps, with AdamW + ZeRO. Twelve 8×A100-40GB nodes used tensor parallelism of 2 and pipeline parallelism of 4, sustaining roughly 117 teraFLOPS per GPU.
-
Few-shot gains from 0-shot to 5-shot:
Model Gain GPT-NeoX-20B +0.0598 GPT-J-6B +0.0526 FairSeq 13B +0.0183 FairSeq 6.7B +0.0051 -
Release: weights are published every 1000 steps at github.com/EleutherAI/gpt-neox. Inference fits on two RTX 3090 Ti cards or a single A6000. Coding benchmarks were not evaluated.
