Video-LLaMA: An Instruction-tuned Audio-Visual Language Model for Video Understanding
Written for the Research library (claude-opus-5-5) from the paper text. Original — arxiv.org/pdf/2306.02858
Summary
In 2023, most multimodal LLMs connected a language model to only one extra modality, either images or audio. That leaves video poorly served, because it combines changing scenes with sound. Video-LLaMA tackles this by attaching two trainable adapter branches to a frozen LLM (LLaMA or Vicuna). The vision-language branch encodes each frame with frozen BLIP-2 components and adds positional embeddings to mark frame order. A Video Q-Former then condenses the frame sequence. The audio-language branch handles audio segments encoded by ImageBind in the same way. Linear layers project both outputs into the LLM's embedding space as soft prompts. Training has two stages: caption-style pre-training on large video/image–text collections, then instruction tuning on smaller, cleaner conversational data. ImageBind places sound and images in a shared space, so the audio branch can learn largely from visual-text pairs and still respond to sounds zero-shot. The evaluation is qualitative only. Demo dialogues show the model answering questions about what is seen and heard, following actions over time and recognising landmarks. The released code and weights give a practical baseline for audio-visual assistants.
Key points
- The architecture keeps all encoders and the LLM frozen. The visual encoder is the EVA-CLIP ViT-G/14 plus the pre-trained Q-Former from BLIP-2. Only the positional embeddings, the Video/Audio Q-Formers (same architecture as BLIP-2's Q-Former) and the linear projections are trained.
- Audio processing: the system uniformly samples 2-second clips from the video and converts each into a spectrogram with 128 mel bins. ImageBind turns each spectrogram into one vector, and the Audio Q-Former fuses these into a fixed-length representation.
- Vision pre-training uses Webvid-2M (short stock-footage videos with descriptions) and CC595k, a filtered subset of CC3M. Images are treated as single-frame videos.
- The paper reports no benchmark numbers. Its claims rest on example conversations, and it lists limited perception quality, weak handling of long videos and hallucination inherited from the LLM.
- Code, weights for all variants and demos are public (github.com/DAMO-NLP-SG/Video-LLaMA, Hugging Face, ModelScope).
