MiniCPM: Unveiling the Potential of Small Language Models with Scalable Training Strategies
Written for the Research library (claude-opus-5-5) from the paper text. Original — arxiv.org/pdf/2404.06395
Summary
Training very large language models is expensive, which makes experiments hard to afford, and the resulting models are difficult to run on phones or laptops. The authors argue that well-trained small language models (SLMs) can run on-device and also serve as a cheap testbed for scaling recipes. They present MiniCPM, two models with 2.4B and 1.2B non-embedding parameters. Hyper-parameters are tuned through "model wind tunnel experiments" on tiny proxy models. These rely on Tensor Program width and depth scaling, so the best learning rate stays the same as the model grows. A fitted law also links the optimal batch size to the target loss. The paper also proposes the Warmup-Stable-Decay (WSD) learning rate scheduler. WSD holds the learning rate constant for most of training and decays it only near the end. This makes checkpoints reusable for continued training and lets scaling laws be estimated with far fewer runs. Both models lead their size classes and come close to 7B–13B models. The scaling study points to a much higher tokens-per-parameter ratio than Chinchilla Optimal. The models are openly released.
Key points
- Models and comparisons: MiniCPM-2.4B and MiniCPM-1.2B are compared against Llama2-7B, Mistral-7B, Gemma-7B and Llama-13B, and reach comparable benchmark quality. Weights and code are at github.com/OpenBMB/MiniCPM.
- Wind tunnel results:
- Batch size: models of 0.009B, 0.03B and 0.17B gave the fit bs ≈ 1.21×10⁹ / L^6.24, where L is the C4 loss.
- Learning rate: the optimal base learning rate stays near 0.01 from 0.04B to 0.5B parameters, and a check at 2.1B confirmed it.
- WSD and scaling laws: With WSD, a data-model scaling study needs effort that grows linearly along the model axis, with almost no extra cost along the data axis. A conventional study grows quadratically because it needs separate runs for every model–data combination. The study finds a compute-optimal data/model ratio well above Chinchilla's.
- MiniCPM family:
- MiniCPM-DPO beats zephyr-7B on MTBench.
- MiniCPM-2.4B-128K matches or beats Yarn-Mistral-7B-128K and ChatGLM3-6B-128K on ∞Bench.
- MiniCPM-MoE is built from the dense checkpoint. It has 13.6B parameters in total, routes each token to 2 of 8 experts (about 4B active parameters), and is on par with Llama2-34B (MMLU 58.90, GSM8K 61.56).
- Limitation: The scaling law and WSD were not tested by actually training a large-scale LLM.
