HELMET: How to Evaluate Long-Context Language Models Effectively and Thoroughly

Paper · 2024 · Howard Yen, Tianyu Gao, Minmin Hou et al.

Summary

Developers of long-context language models (LCLMs) tend to report synthetic needle-in-a-haystack (NIAH) scores or a hand-picked set of datasets. This makes models hard to compare and says little about real-world usefulness. The authors argue that existing benchmarks give noisy signals for four reasons: they cover few applications, use inputs that are too short, rely on weak metrics such as ROUGE, and work only with instruction-tuned models. HELMET addresses this with seven application-oriented categories: RAG, generation with citations, passage re-ranking, many-shot ICL, long-document QA, summarization and synthetic recall. Input length is adjustable up to 128K tokens. QA and summarization are scored by a model against reference answers, and few-shot prompts allow base models to be tested. The authors evaluated 59 LCLMs. HELMET ranked frontier models more consistently than earlier benchmarks. NIAH-style results proved a poor guide to downstream ability, and the categories correlated only weakly with one another. Open-source models trailed closed ones on tasks that need reasoning over the full context or following complex instructions. The work matters because it offers a cheaper and more trustworthy way to steer long-context model development.

Key points

  • Scale and anomalies: The study covers 59 LCLMs at controllable lengths up to 128K tokens. On older benchmarks, results at 128K looked odd: on RULER, Gemini-1.5 Flash beat Gemini-1.5 Pro, and on ∞BENCH, Llama-3.1 70B scored below the 8B model.
  • Datasets by category:
    • RAG: Natural Questions, TriviaQA, PopQA and HotpotQA, scored with SubEM.
    • Citations: ALCE ASQA and ALCE Qampari.
    • Re-ranking: MS MARCO, scored with NDCG@10.
    • ICL: TREC Coarse, TREC Fine, NLU, BANKING77 and CLINC150.
    • QA: NarrativeQA plus ∞BENCH QA and MC.
    • Summarization: ∞BENCH Sum and Multi-LexSum.
    • Synthetic recall: JSON KV plus several RULER variants.
  • Harder RAG distractors: Instead of random passages, distractors are retrieved with gte-large-en-v1.5 from a Wikipedia 2019-8-01 dump split into 100-word passages. Gold passages are placed at several positions in the context.
  • Open vs. closed gap: Almost all models saturate NIAH, but open models fall further behind closed ones as context length grows.
  • Practical advice: The authors suggest the RAG tasks as a quick development proxy, since they are simple to run, suit base models and predict other categories well. They still recommend broad multi-task evaluation for a full picture.
