How to Train Long-Context Language Models (Effectively)
Paper · 2025 · Tianyu Gao, Alexander Wettig, Howard Yen et al.
Summary
The paper asks how to turn a short-context pre-trained LM into a strong long-context model through continued pre-training followed by SFT. The authors first argue that perplexity and simple NIAH tests are poor guides for development. Instead, they use a varied subset of HELMET tasks: recall, RAG, re-ranking, ICL, book QA and summarization. They score models only after SFT and also check that standard short-context benchmarks do not degrade. With this protocol, they run ablations on Llama-3-8B covering long-data sources, the long/short mixing ratio, training length, position extrapolation and instruction data. The resulting recipe yields ProLong-8B. It combines code repositories and books with a carefully chosen short-data mix, trains at lengths beyond the evaluation target, and uses only short instruction data for SFT. ProLong-8B is state of the art at 128K among models of similar size and beats Llama-3.1-8B-Instruct on most long-context tasks with a small fraction of the training budget. Code, data and models are publicly released, giving open practitioners a tested recipe.
Key points
- Training and context length: ProLong-8B starts from Llama-3-8B (8K native context) and is trained on 40B tokens, 20B at 64K length and 20B at 512K. It handles inputs up to 512K tokens while using roughly 5% of the long-context training tokens of Llama-3.1.
- Long-data sources: Whole repositories from the Stack, concatenated into single documents, mainly improve recall. Books help more with re-ranking, ICL and summarization, and a 1:1 Books/Repos mix scores best overall.
- Short-data mix: Long data makes up 60% of training and a "ShortMix" makes up the other 40%. ShortMix draws on FineWeb, FineWeb-Edu, Wikipedia, Tulu-v2, StackExchange, ArXiv and OpenWebMath. In ablations it gave a long-context average of 54.6 and a short-context average of 65.5, compared with 66.0 for the original Llama-3-8B.
- SFT findings: Standard short instruction data such as UltraChat is enough for good long-context results, and synthetic long instructions bring no extra gain. Some improvements, for example on RAG and re-ranking, only become visible after SFT.
- NoCha results: On NoCha, ProLong reaches 28.4 on inputs under 75K tokens. It is the only 10B-scale model there that beats random guessing (25%), and it is the strongest of its size class on inputs over 180K.
