Data Interpreter: An LLM Agent for Data Science
Paper · 2025 · Sirui Hong, Yizhang Lin, Bang Liu et al.
Summary
Data science work, such as building ML pipelines, analysing tables or solving maths problems, rarely follows a simple chain of steps. Stages branch, loop back and depend on each other in ways that are often unstated, so LLM agents that write one large block of code tend to spread early mistakes downstream and lose track of long context. The authors propose Data Interpreter, an open-source agent that represents a project as a two-level graph. A task graph (a DAG of subtasks) is expanded into an action graph of small executable code steps. A graph executor runs each node, checks the result, and revises nodes or the plan when execution feedback shows a problem. The graph also acts as structured memory, keeping later steps consistent with earlier ones. Across data analysis, machine learning, open-ended and mathematical benchmarks, the agent clearly beats open-source frameworks such as AutoGen, OpenHands and AIDE. This suggests that structured, stepwise planning matters as much as raw model strength for automating data science.
Key points
- On InfiAgent-DABench, accuracy rises from 75.9% to 94.9%. On ML tasks it goes from 88% to 95%, and on open-ended tasks from 60% to 97%. On MATH it beats the strongest baselines by 26%, though only level-5 problems were tested because of budget limits.
- In an ablation on ML-Benchmark, plain code execution with ReAct averaged 0.37. Adding iterative graph refinement raised this to 0.85, and the full system reached 0.94.
- On MLE-Bench-Lite, the agent is competitive with AIDE and OpenHands. Each task took under 900 seconds at about $0.37, while the baselines ran for roughly 24 hours.
- The framework also helps reasoning-oriented models: QwQ-32B improves from 0.296 to 0.411, and DeepSeek-V3 from 0.501 to 0.551.
- The authors name three limitations. There is no explicit DAG cycle detection, no loop for repeated experiments or hyperparameter tuning, and smaller LLMs struggle with tasks that demand heavy coding.
