MLGym: A New Framework and Benchmark for Advancing AI Research Agents

Paper · 2025 · Deepak Nathani, Lovish Madaan, Nicholas Roberts et al.

Summary

LLM agents are now used for software and ML engineering. Yet there has been no shared environment for testing how they handle open-ended AI research, and none that supports training them with learning algorithms. The authors introduce MLGym, a framework that exposes research tasks through a Gym interface. Agents work inside a computer environment using a shell, file system and tools, and they receive feedback suitable for reinforcement learning, curriculum or open-ended learning. They also release MLGym-Bench, 13 open-ended tasks from computer vision, natural language processing, reinforcement learning, game theory and SAT. Agents can submit different kinds of results, such as model weights, RL algorithms or strategy code. Five frontier LLMs are compared under identical settings using a new aggregate metric drawn from optimization and AutoML. The agents usually beat the supplied baselines, but mostly by tuning hyperparameters rather than inventing new methods or architectures. The open-source release gives the community a reproducible testbed and a scale for tracking progress toward autonomous research agents.

Key points

  • MLGym is presented as the first Gym environment for AI Research Agents. Code is at github.com/facebookresearch/MLGym.
  • MLGym-Bench contains 13 diverse open-ended tasks. Compared with MLE-Bench, SWE-Bench/SWE-agent, MLAgentBench, RE-Bench and ScienceAgentBench, it is the only one that combines a Gym interface, algorithmic tasks and flexible artifacts.
  • The evaluated models are Claude-3.5-Sonnet, Llama-3.1 405B, GPT-4o, o1-preview and Gemini-1.5 Pro.
  • The authors define six capability levels, from Level 0 (Reproduction) to Level 5 (Long-Term Research Agenda). The benchmark targets Level 1, Baseline Improvement.
  • The cross-task metric builds on performance profiles (Dolan and Moré, 2002) and AutoML work. It allows fair comparison of agents across tasks that use different native metrics.
