SciAgent: Tool-augmented Language Models for Scientific Reasoning

Paper · 2024 · Yubo Ma, Zhibin Gou, Junheng Hao et al.

Summary

Even strong LLMs often fail at STEM problems because they need both mathematical skill and specialised domain knowledge. Fine-tuning a separate model for each field would require costly annotation every time. The authors instead propose tool-augmented scientific reasoning. A single model learns to be a good tool user and receives a pluggable, domain-specific set of Python functions at inference time, so no further fine-tuning is needed.

To train such a model, they used GPT-4/-4o in an automatic pipeline to build MathFunc from the MATH training set. The pipeline generated reusable, documented functions and solutions that call them, and it corrected failures using execution feedback. Open-source LLMs fine-tuned on this corpus become SciAgent. The agent drafts a plan, retrieves relevant functions, writes a mixed natural-language and Python solution, and runs the code.

For evaluation, the authors built SciToolBench across five domains. SciAgent models clearly beat comparable open models, and one variant outperforms ChatGPT. This suggests that tool-use ability plus math skill transfers across scientific fields.

Key points

  • MathFunc contains 31,375 training samples and a toolset of 5,981 math-related functions. Each sample includes a question, plan, retrieved functions, solution and answer.
  • SciToolBench builds on TheoremQA and SciBench. It has 4,250 questions in Mathematics, Physical, Chemistry, EECS and Finance, with five toolsets totalling 2,285 functions.
  • SciAgent-Llama3-8B beats similarly sized LLMs by over 8.0% absolute accuracy, and SciAgent-DeepMath-7B substantially outperforms ChatGPT.
  • On problems where the agent actually calls retrieved functions, accuracy is about 25% higher in absolute terms than MAmmoTH-Coder without tools. However, accuracy stays near 40% even with perfect hit@3 retrieval.
  • Model rankings on auto-synthesized and human-annotated questions agree closely (Spearman 0.903), which supports the use of synthesized benchmark items.
