REAR: A Relevance-Aware Retrieval-Augmented Framework for Open-Domain Question Answering
Paper · 2024 · Yuhao Wang, Ruiyang Ren, Junyi Li et al.
Summary
Retrieval-augmented generation (RAG) helps large language models answer open-domain questions. However, the retrieved passages often include irrelevant material that can lead the model to wrong answers. Earlier robustness methods such as Self-RAG and RobustLM judge relevance only with binary labels, which gives coarse signals. REAR adds an explicit assessment module to the LLM: a linear layer turns the model's final hidden state for each query–document pair into a relevance score. That score is embedded as a vector and fed back to steer generation, so the model can rely on the document or on its own parametric knowledge. A final verification step picks the answer using either source reliability or knowledge consistency. Training combines two ideas. Bi-granularity relevance fusion mixes coarse binary and fine-grained graded supervision. Noise-resistant training pairs gold documents with sampled negatives. The training data is built without GPT APIs. On four open-domain QA benchmarks, REAR beats competitive RAG baselines and stays robust to noisy or weak retrieval. This matters for building reliable QA systems.
Key points
- On NQ with only the top-1 retrieved document, REAR 7B reaches 46.79 overall EM/Acc, compared with 40.03 for Self-RAG 7B and about 30 for 4-shot LLaMA2 13B.
- The gain comes mostly from irrelevant documents. There REAR scores 20.09 versus 6.23 for Self-RAG, while both score about 73–74 on relevant documents.
- Removing the bi-granularity loss, noise-resistant training, or the negative-sampling strategy each lowers performance.
- REAR remains strong across retrievers of varying quality (BM25, Contriever-msmarco, a FiD-distilled retriever), with the largest margin under BM25.
- Code is available at github.com/RUCAIBox/REAR. The authors list sentence- and token-level guidance and KILT-style tasks as open future work.
