Building Cooperative Embodied Agents Modularly with Large Language Models
Paper · 2023 · Hongxin Zhang, Weihua Du, Jiaming Shan et al.
Summary
The paper studies teamwork between embodied agents that each act alone, see only partial raw sensory input, pay a time cost for every message, and share long-horizon household tasks with several sub-goals. Earlier work usually assumed free messaging or a central planner with pooled observations. The authors formalize the setting as DEC-POMDP-COM, a DEC-POMDP extended with an explicit communication action, and test it in two environments, TDW-MAT and C-WAH. Their agent, CoELA, has five cognitively inspired modules: perception, memory, communication, planning and execution. An LLM writes natural-language messages and chooses high-level plans, while the other modules handle sensing and low-level control. With GPT-4, CoELA outperforms strong planning-based baselines by more than 40% in efficiency, and useful communication arises without dedicated training. Open models such as LLAMA-2 perform worse, but CoLLAMA, a LoRA-tuned version trained on a small amount of agent-collected data, shows promising results. A user study suggests people trust and cooperate better with an agent that speaks natural language. This makes LLMs credible building blocks for decentralized multi-agent cooperation.
Key points
- Setting: The experiments focus on two agents with noise-free broadcast messaging. The agents' actions are navigation, interaction, or sending a natural-language message. The team reward counts sub-goals reached minus the cost of actions. The method is described as extendable to more agents.
- Memory design: The Memory Module is split into three parts:
- semantic memory, holding the map, task progress and agent states;
- episodic memory, holding action and dialogue history;
- procedural memory, holding agent code and LLM parameters.
- Main result: GPT-4-driven CoELA beats planning baselines, including an MCTS-based Hierarchical Planner (HP), by over 40% in efficiency on C-WAH and TDW-MAT.
- Fairer baseline: To level the comparison, the HP baseline was given template messages of three kinds, which can be merged into a single message:
- Progress sharing;
- Intent sharing;
- Belief sharing.
- Open models and humans: CoLLAMA is LLAMA-2 fine-tuned with LoRA on agent-collected data and narrows the gap to GPT-4. In the user study, natural-language communication raised human trust and improved cooperation.
