AutoML-GPT: Automatic Machine Learning with GPT
Paper · 2023 · Shujian Zhang, Chengyue Gong, Lemeng Wu et al.
Summary
Selecting a model architecture, optimizer and hyperparameters for a new task still takes considerable manual effort. AutoML-GPT addresses this by letting a large language model (ChatGPT) act as a controller that coordinates existing expert models. The user describes a task with two structured documents. A data card gives the dataset name, input type, label space and default metric. A model card gives the model name, structure, description and architecture hyperparameters. Users can also add extra metrics or constraints. These inputs are combined into a fixed-format prompt paragraph. From it, the LLM proposes preprocessing steps, assigns models to tasks and suggests hyperparameters. Instead of running real training, it generates a predicted training log that guides further tuning. For unseen datasets, the system compares the new data card with known ones to transfer prior knowledge. The authors present use cases in computer vision, question answering and classification. For example, XGBoost on UCI adult reached a validation loss of 0.277 after real training with the suggested settings. The work matters as an early natural-language interface for ML tuning. However, the supplied text omits most quantitative results.
Key points
- The pipeline has four stages: data processing, model architecture design, hyperparameter tuning with a predicted training log, and human feedback on results.
- Inputs follow the model card (Mitchell et al., 2019) and data card (Gebru et al., 2021) documentation formats, plus optional user constraints such as an inference-speed limit.
- Models are matched to tasks through an in-context task-model assignment mechanism. Training logs are generated by the LLM rather than computed on hardware.
- In the classification case on UCI adult, the suggested XGBoost settings were 100 trees, max depth 6 and learning rate 0.3, giving a final validation loss of 0.277.
- Planned future work includes producing model and data cards automatically for widely used benchmark datasets, as well as extracting task-aware sub-networks from large pretrained models.
