Vision-R1: Incentivizing Reasoning Capability in Multimodal Large Language Models
Paper · 2025 · Wenxuan Huang, Bohan Jia, Zijie Zhai et al.
Summary
The paper asks whether reinforcement learning, which DeepSeek-R1-Zero used to elicit reasoning in text-only LLMs, can do the same for MLLMs. Applying RL directly to a multimodal model (the Vision-R1-Zero variant) did not produce rich reasoning behaviours such as self-questioning or reflection, mainly because good multimodal reasoning data is scarce. The authors therefore combine a cold start with RL. To build cold-start data without human labelling, an existing MLLM first converts each image into a detailed textual description ("Modality Bridging"). DeepSeek-R1 then reasons over that text, and rule-based filters keep only good traces. The result is a 200K-sample CoT corpus. After this initialization, the model tended to overthink: its correct answers clustered in short reasoning chains, which made RL optimization difficult. Progressive Thinking Suppression Training (PTST) addresses this by keeping reasoning short early in GRPO training and allowing longer chains in later stages. The 7B model nearly matches OpenAI O1 on MathVista, which shows that small MLLMs can compete with much larger systems in visual math reasoning.
Key points
- Vision-R1-cold dataset: about 200K multimodal CoT samples, built without human annotation from an existing MLLM plus DeepSeek-R1 and rule-based filtering. It serves as cold-start initialization data.
- Training method: GRPO with a hard-formatting result reward, scheduled by PTST. With only 10K multimodal math examples for RL, it gives roughly a 6% average gain across multimodal math benchmarks.
- Vision-R1-7B: 73.5% on MathVista, only 0.4 points behind OpenAI O1. It performs comparably to MLLMs with 70B+ parameters on math reasoning.
- Larger models: with more RL math data, Vision-R1-32B and Vision-R1-72B score 76.4% and 78.2% on MathVista. They improve on their base models by around 10% on average across multimodal math benchmarks.
- Release: the datasets, weights and code are announced at github.com/Osilly/Vision-R1.
