G-LLaVA: Solving Geometric Problem with Multi-Modal Large Language Model

Paper · 2023 · Jiahui Gao, Renjie Pi, Jipeng Zhang et al.

Summary

Multimodal LLMs, including GPT-4-V, often misread geometric diagrams. They confuse how points and lines relate, misjudge angles and hallucinate figure contents, so they struggle with geometry problems that require visual input. Public geometry datasets are also small and lack image descriptions. The authors address this by using a text-only LLM (ChatGPT) to expand existing geometry data into Geo170K. The method relies on properties specific to geometry: unambiguous logic forms, diagrams that can be fully described in text, and problems that can be rescaled or rephrased. The result is a corpus of diagram captions and question-answer pairs. On this data they train G-LLaVA in two stages: a cross-modal alignment stage on captions and contrastive questions about basic elements, then instruction tuning on problem solving. G-LLaVA-7B beats GPT-4-V on the geometry problem-solving portion of MathVista. This shows that targeted synthetic data can matter more than model scale for domain-specific visual reasoning.

Key points

  • Geo170K composition: roughly 60K image-caption pairs and over 110K QA pairs, about 28× the size of GeoQA+.

  • Augmentation strategies:

    • recovering diagram descriptions from QA pairs and logic forms
    • contrastive QA about basic elements
    • value scaling
    • substituting variables and solving equations
    • turning a given condition into the unknown
    • paraphrasing
  • MathVista results: on the GPS minitest split, G-LLaVA-13B scores 27.4 points above LLaVA-13B, and G-LLaVA-7B surpasses GPT-4-V.

  • GeoQA top-1 accuracy:

    ModelAccuracy
    G-LLaVA-7B64.2%
    G-LLaVA-13B67.0%
    LLaVA-7B18.7%
    LLaVA-13B20.3%
    UniMath50.0%
    Geoformer46.8%
  • Alignment ablation: removing the alignment phase lowers G-LLaVA-7B on GeoQA from 64.2% to 62.8%. Code and data are released at github.com/pipilurj/G-LLaVA.
