LLaMA-Adapter V2: Parameter-Efficient Visual Instruction Model

Paper · 2023 · Peng Gao, Jiaming Han, Renrui Zhang et al.

Summary

Making LLaMA follow open-ended instructions about images has usually required updating billions of weights and collecting large multi-modal instruction sets, as MiniGPT-4 and LLaVA do. The original LLaMA-Adapter could accept images, but when trained on COCO Caption it mostly produced short captions. LLaMA-Adapter V2 addresses this with three changes. First, it unfreezes normalization, bias and scale parameters throughout LLaMA, so instruction-following knowledge is not confined to the adapters. Second, it injects visual tokens only into the early Transformer layers, away from the layers that hold the adaptation prompts. Third, it trains jointly on image-text pairs and language-only instruction data, with each data type updating a separate parameter group. This keeps visual alignment from eroding instruction skills. At inference, external tools such as captioners or OCR add textual context about the image without extra training. The model answers open-ended visual questions and holds multi-turn chats while adding only about 14M parameters. This makes it a cheap route to multimodal assistants, although it still trails LLaVA on visual understanding.

Key points

  • Only ~14M parameters are tuned on top of LLaMA, versus 13B for MiniGPT-4 and LLaVA. The bias/norm/scale tuning alone covers about 0.04% of the model.
  • Training data: 52K single-turn GPT-4-LLM instructions plus 567K COCO image-text pairs, with no visual instruction data. By comparison, LLaVA uses 158K visual instructions and MiniGPT-4 uses 134M image-text pairs.
  • Early fusion: visual prompts go into the first K layers (K < N − L), whereas the original LLaMA-Adapter added them in the last L layers.
  • Expert models plug in at inference: LLaMA-Adapter acts as the captioner, and OCR is demonstrated on DocVQA examples. Detection systems are also mentioned.
  • The authors note two limitations: the model is weaker than LLaVA on visual understanding and is vulnerable to errors from the experts. They plan future work with multi-modal instruction data and LoRA.
