DataSciBench: An LLM Agent Benchmark for Data Science
Paper · 2026 · Dan Zhang, Sining Zhoubian, Min Cai et al.
Summary
Most benchmarks for LLMs in data science test isolated tasks with simple metrics such as accuracy and with ground truth that is easy to obtain. Real analysis work chains several steps, such as cleaning, statistics, modelling and visualisation, and correct answers are often not known in advance. DataSciBench targets this gap. The authors gathered 222 realistic, demanding prompts from CodeGeeX, BigCodeBench (BCB) and human authors, then filtered them and had experts review them. The prompts span six task categories.
Ground truth comes from a semi-automated process: a strong LLM produces candidate answers, self-consistency checks filter them, and humans verify the result. Scoring relies on the Intention-Function-Code (IFC) framework. It links each prompt's intent to a verifiable evaluation function and code, and it applies programmatic rules to compare outputs against the ground truth.
The authors tested 26 models. API-based systems clearly beat open-source ones, with GPT-4o strongest overall and DeepAnalyze-8B the best open model. All models remain weak at following detailed instructions, using tools correctly and exporting the required outputs. This makes the benchmark a useful diagnostic for data-analysis agents.
Key points
- Resource scale: 222 prompts across six task types, 519 IFC-based test cases with ground truth, and 25 aggregate evaluation functions. Code and data are public at github.com/THUDM/DataSciBench.
- Models evaluated: 26 models, comprising 8 API-based, 8 open general-purpose, 9 code-generation and 1 agentic model.
- Evaluation levels:
- Coarse-grained: success rate and completion rate.
- Fine-grained: VLM-as-a-judge plus the aggregate functions.
- Difficulty split: 167 easy, 30 medium and 25 hard prompts. GPT-4o, GPT-4o-mini, GPT-4-Turbo and DeepSeek-Coder-33B-Instruct performed stably across all levels.
- Notable failures:
- o1-mini reached only a 29.77% overall success rate. Its main errors were ignoring instructions, calling nonexistent functions and forgetting to save outputs.
- CodeLlama-34B-Instruct scored below its 13B and 7B versions.
- The authors acknowledge that evaluation of visualisations still lacks precision.
