AndroidLab: Training and Systematic Benchmarking of Android Autonomous Agents
Paper · 2025 · Yifan Xu, Xiao Liu, Xueqiao Sun et al.
Summary
Research on Android agents has lacked a common framework where open and proprietary models can be both trained and fairly compared. Most earlier benchmarks were static or tested only closed models through prompting. AndroidLab addresses this with an interactive environment that gives text-only LLMs and multimodal VLMs one shared action space. LLMs use an XML mode built on compressed UI trees, and VLMs use a SoM mode built on numbered screenshot elements. ReAct and SeeAct prompting run on top of either mode. The accompanying benchmark runs on offline, preloaded Android virtual devices for reproducibility. Each task is split into sub-goals, which are verified by matching UI-tree and device states, so any valid path to completion counts. The authors evaluated 17 models and also built the Android Instruct dataset with an online annotation tool. After six open models were fine-tuned on it, average success for LLMs climbed to 21.50% (up from 4.59%), while VLMs improved to 13.28% (up from 1.93%). This brings small open models close to proprietary ones and makes private, on-device-friendly deployment more realistic.
Key points
- The benchmark has 138 tasks across nine apps: Clock, Settings, Contacts, Calendar, Bluecoins, MAPS.ME, Pi Music, Zoom and Cantook. Its actions are Tap, Swipe, Type, Long Press, Home, Back and Finish.
- Four metrics are reported: Success Rate, Sub-Goal Success Rate, Reversed Redundancy and Reasonable Operation. The last two capture how efficient the agent's actions are.
- The best closed-model result is 31.16%, reached by GPT-4-1106-Preview in XML mode and by GPT-4o in SoM mode.
- Annotation produced 10,500 traces with 94,300 steps. Of these, 726 traces (6,208 aligned XML/SoM steps) from the benchmark apps were used for fine-tuning.
- The fine-tuned models were Llama-3.1-8B-Instruct, GLM-4-9B-Chat, Qwen2-7B-Instruct, Qwen2-VL-7B-Instruct, CogVLM2 and Llama-3.2-11B-Vision. The code is released at github.com/THUDM/Android-Lab.
