EfficientQAT: Efficient Quantization-Aware Training for Large Language Models

Paper · 2025 · Mengzhao Chen, Wenqi Shao, Peng Xu et al.

Summary

Quantization-aware training (QAT) can compress large language models to very low bit-widths with little accuracy loss. However, standard QAT trains the whole network end-to-end and requires substantial GPU time and data, which makes it impractical for big LLMs. Cheaper alternatives, such as PTQ and quantized parameter-efficient fine-tuning (Q-PEFT), lose considerable accuracy at 2–3 bits.

The authors propose EfficientQAT, a two-stage uniform weight-quantization pipeline:

  • Block-AP goes through the transformer one block at a time. It optimizes the original weights together with step sizes and zero points against a reconstruction loss.
  • E2E-QP then freezes the integer weights and tunes only the step sizes across the full model. This captures interactions between blocks at low memory cost.

Experiments cover base, instruction-tuned and multimodal LLMs ranging from 7B to 70B parameters. EfficientQAT outperforms earlier uniform PTQ, QAT and Q-PEFT methods and is competitive with vector quantization. Because the output is standard uniform quantization, the models can run with existing inference kernels. This makes strong low-bit LLMs achievable on a single GPU.

Key points

  • 70B on one GPU: a 2-bit Llama-2-70B was produced on a single A100-80GB in about 41 hours. Its average zero-shot accuracy on 5 common-sense tasks was 69.48, versus 72.41 at full precision.
  • Training cost: total training took 4.8h for Llama-2-7B, 8.5h for 13B and 40.9h for 70B. For 70B this is roughly half the GPU hours of DB-LLM (41 vs 82), while competing methods need at least 4 GPUs.
  • Gains over baselines: EfficientQAT beats uniform quantization baselines by about 5 accuracy points at 2 bits. With Alpaca fine-tuning, it exceeds PEQA by 4.5 MMLU points.
  • Ablation (Llama-2-7B, w2g64): average accuracy was 40.69 with neither stage, 58.99 with Block-AP alone, 55.71 with E2E-QP alone and 60.14 with both stages. By default, 4096 training samples are used.
  • Inference speed: INT2 models accelerate the forward pass by roughly 2.9–4.4× via BitBLAS. Code is available at github.com/OpenGVLab/EfficientQAT.
