Among Us: Measuring and Mitigating Malicious Contributions in Model Collaboration Systems
Paper · 2026 · Ziyuan Yang, Wenxuan Ding, Shangbin Feng et al.
Summary
Multi-LLM systems increasingly combine models built by different parties, which raises the question of how a compromised participant affects the whole. The authors build malicious LMs in four ways. Two act at inference time: adversarial prompting and persona-vector activation steering. Two change the weights: SFT on GPT-4o-generated wrong or unsafe answers, and GRPO training with an inverted reward. They insert these models into eight collaboration methods at four levels: API-level routing, text-level debate/feedback, logit-level decoding and weight-level merging. Testing spans ten datasets in five task areas, including safety, reasoning, knowledge, code and instruction-following. Malicious participants clearly hurt performance, with routing and the reasoning and safety domains most affected. As a defence, the authors try two options. In one, collaborating models check each other's outputs (supervisor-free). In the other, an outside judge or reward model switches off suspicious members (supervisor-based). These defences restore most of the original performance. Malicious behaviour learned in one domain can carry over to others, and blocking that transfer is still unsolved. The work offers an early benchmark for security in decentralized, compositional AI.
Key points
- Four ways to build malicious models are compared: M1 prompting, M2 activation steering, M3 SFT on five adversarial domain datasets, and M4 RL with inverted rewards via GRPO.
- Eight collaboration methods are tested: LLM Router, Graph Router, Text Debate, Text Feedback, Logit Average, Logit Contrastive, Greedy Soup and DARE TIES.
- Average worst-case degradation is 34.9%. Routing loses 13.8% on average, while reasoning drops 7.12% and safety drops 7.94%.
- Across strategies, mitigation recovers about 95.31% of initial performance on average, and supervisor-based methods reach about 96.8%. LLM-as-a-judge and reward-model supervisors perform similarly. Mitigation was only evaluated for API- and text-level systems.
- Code is released at github.com/Ziyuan-Yang/AmongUs (ACL 2026).
