Stepwise Reasoning Disruption Attack of LLMs
Paper · 2025 · Jingyu Peng, Maolin Wang, Xiangyu Zhao et al.
Summary
LLMs are often accessed through third-party platforms and APIs. This means an intermediary could quietly tamper with a model's reasoning while the output still looks normal. The authors study this risk for multi-step reasoning, where one flawed early step can spread through the whole chain. Earlier reasoning attacks either depend on in-context demonstrations (BadChain) or produce outputs users can easily spot (the preemptive-answer attacks UPA/MPA).
The paper proposes SEED (Stepwise rEasoning Error Disruption), a black-box, prompt-only attack. An attacker LLM writes the opening reasoning steps with a subtle mistake, and the target model continues from there. The user then sees the injected and generated steps merged into one coherent chain-of-thought. The instruction is never changed, and the attack works in both zero-shot and few-shot settings.
Tests on four LLMs and four datasets, including MATH and CSQA, show high attack success with strong stealth. This exposes a real weakness in step-dependent reasoning and motivates defenses for reasoning integrity.
Key points
- SEED comes in two variants:
- SEED-S alters the final step among the injected prior steps.
- SEED-P secretly solves a slightly altered version of the problem that leads to a chosen wrong answer, then presents those steps as if they solved the original problem.
- A hyperparameter σ controls the ratio between injected steps and the total number of reasoning steps. Injecting too many prior steps makes the model more robust, because it starts reviewing and correcting earlier reasoning rather than simply continuing.
- The authors report that editing the instruction (I_solve) or the problem text is relatively easy to detect, and editing demonstrations is impossible in zero-shot use. This motivated the choice to append misleading reasoning steps instead.
- The authors note that BadChain has a detection rate of nearly 100%. They argue it is both limited to in-context learning and highly conspicuous.
- Code is available at github.com/Applied-Machine-Learning-Lab/SEED-Attack. The authors list as limitations that budget constraints prevented evaluation on full datasets, and that the attack may generate harmful content.
