BlindGuard: Safeguarding LLM-based Multi-Agent Systems under Unknown Attacks
Paper · 2026 · Rui Miao, Yixin Liu, Yili Wang et al.
Summary
BlindGuard addresses the defense of LLM-based multi-agent systems (MAS) against malicious agents whose misleading messages spread through agent interactions and corrupt the group's final decision. Earlier graph-based defenses such as G-Safeguard train supervised graph anomaly detection (GAD) models. These require labeled attacker agents and tend to handle only the attack type they were trained on. BlindGuard is unsupervised and learns only from benign MAS interaction graphs. Its hierarchical agent encoder combines three views of each agent: its own features, aggregated neighbor information, and system-wide context. A corruption-guided detector then creates artificial anomalies by injecting directional, semantic-level noise into normal agent representations. It trains on these with a supervised contrastive objective. Agents that receive high anomaly scores are cut off through edge pruning. Across four communication topologies and three attack types, BlindGuard detects attackers reliably. When the attack type was not seen during training, it generalizes better than G-Safeguard. This makes it a more practical option for real deployments, where attacks are unknown or keep changing.
Key points
- Evaluation setup: four MAS topologies (Random, Chain, Star, Tree) and three attack families: prompt injection (PI), memory poisoning (MA), and tool exploitation (TA). Datasets include CSQA and PoisonRAG. Metrics are AUC for detection and ASR@3 for defense.
- Generalization: a model trained on PI and tested against unseen MA attacks on CSQA beat the supervised G-Safeguard baseline on most topologies.
- Scalability: on PoisonRAG with 20- and 50-agent systems, BlindGuard kept ASR@3 between roughly 1.8% and 5.6% across rounds R1–R3. Without defense, ASR@3 ranged from about 5.7% to 29.5%.
- Ablation: removing the neighbor-level or global-level features hurt both detection and defense, and removing both caused the steepest decline.
- Limitations: the system has only been tested in simulated environments. It also responds after an intrusion rather than preventing one, so it is intended to complement preventive defenses.
