Explainable and Fine-Grained Safeguarding of LLM Multi-Agent Systems via Bi-Level Graph Anomaly Detection

Paper · 2026 · Junjun Pan, Yixin Liu, Rui Miao et al.

Summary

LLM-based multi-agent systems (MAS) can be compromised when one or a few agents are hijacked through prompt injection, memory poisoning, or tool exploitation, and their harmful outputs then spread to other agents. Earlier graph anomaly detection (GAD) defenses each have gaps. G-Safeguard is supervised and needs labels. BlindGuard is unsupervised. Both represent every agent's reply with one sentence embedding, which can hide attacks concentrated in a few tokens, and neither explains its decisions.

The authors propose XG-Guard, an unsupervised framework trained only on clean MAS interaction graphs. It has three parts:

  • a bi-level encoder that uses SentenceBERT to produce both token-level and pooled sentence-level agent features;
  • a theme-based detector that flags agents whose replies drift from the dialogue's current focus;
  • a fusion step that aligns the two levels' anomaly scores and assigns each token a contribution score as an explanation.

Flagged agents are cut off from further communication. Across several topologies, attack types and backbone LLMs, XG-Guard outperforms unsupervised baselines, and its token highlights point to manipulative or privacy-seeking phrases. This makes MAS defenses more transparent and easier to diagnose.

Key points

  • Evaluation setup:
    • Scenarios: MA-CSQA, MA-PoisonRAG, TA-InjecAgent and a prompt-injection setting on CSQA.
    • Topologies: Random, Chain, Tree and Star.
    • Backbones: gpt-4o-mini, DeepSeek-V3 and Qwen3-30B-A3B.
  • Baselines and metrics: XG-Guard is compared with DOMINANT, PREM, TAM, BlindGuard and the supervised G-Safeguard. Measures include ASR@3 and MAS accuracy over dialogue turns.
  • Ablation, Tree topology: the full model scores 89.78 (PI), 99.56 (TA) and 99.11 (MA).
    • Removing token features ("–Token") lowers TA to 90.67.
    • Replacing fusion with simple averaging ("–Fusion") drops TA to 48.27.
    • This shows that score alignment between the two levels is crucial.
  • Ablation, Star topology: the full model reaches 91.11, 99.11 and 98.67 on the same three settings.
  • Explanation limitation: explanations sometimes highlight punctuation, because the black-box encoder packs nearby context into those tokens.
