Skywork-Reward-V2: Scaling Preference Data Curation via Human-AI Synergy
Paper · 2025 · Chris Yuhao Liu, Liang Zeng, Yuzhen Xiao et al.
Summary
Open reward models used in RLHF are fragile. High RewardBench scores often fail to carry over to other evaluations, and tweaks to losses or architectures have brought little real progress. The authors argue that the bottleneck is the preference data itself, which is often narrow, synthetically labeled or poorly checked. They assemble SynPref-40M, a pool of 40 million preference pairs, and curate it in two stages. In the first stage, annotators follow a strict protocol, using search engines and frontier LLMs as aids, to build a verified gold set. LLM judges, prompted with similar human-labeled examples, label further data, and an iteratively retrained reward model points to pairs where it still errs. In the second stage, curation runs without humans: in-the-wild pairs are filtered by consistency with a gold-trained RM. The resulting 26 million pairs train Skywork-Reward-V2, eight Bradley-Terry reward models from 0.6B to 8B that reach state-of-the-art results on seven benchmarks. The work shows that careful curation, not just scale or new objectives, drives reward-model quality.
Key points
- Resources: the SynPref-40M dataset (40M pairs, 26M curated) and the Skywork-Reward-V2 series of eight models (0.6B–8B), released via Hugging Face, ModelScope and GitHub.
- Evaluation covers RewardBench, RewardBench v2, PPE Preference, PPE Correctness, RMB, RM-Bench and JudgeBench. The 8B model ranks first among open RMs on all seven, and the 1.7B model beats the strongest 70B RM on average.
- Diagnosis of prior work: 16 of the top 20 RewardBench models share the same base model or very similar training data. RewardBench also correlates weakly with newer benchmarks.
- Curation ablations: plain LLM filtering adds only +0.1, human curation gives the largest gain (+2.3), and adding retrieved gold examples to LLM prompts adds +0.9.
- Human-annotation ablations: raw labeling yields +0.4, adding preference attributes yields +1.1, and the full verification protocol with tools yields +3.2 over the seed RM (71.0 → 74.2).
