Humans or LLMs as the Judge? A Study on Judgement Biases
Paper · 2024 · Guiming Hardy Chen, Shunian Chen, Ziche Liu et al.
Summary
Open-ended LLM benchmarks increasingly rely on human annotators or strong LLMs to choose the better of two answers. Both kinds of judges, however, may be swayed by factors unrelated to answer quality. Earlier bias studies typically needed gold labels or reference answers, which open-ended tasks often lack. The authors propose a reference-free, intervention-style framework. A control group of answer pairs is compared with an experimental group in which one answer has been perturbed, and the resulting shift in preference is measured as Attack Successful Rate (ASR). The study probes four biases: Misinformation Oversight, Gender, Authority and Beauty. Each is tested by injecting factual errors, gender-biased remarks, fake references or visually rich formatting, respectively. GPT-4 generated the questions, answers and perturbations, with questions spread across the levels of the revised Bloom's Taxonomy. Every judge tested showed notable bias, though the patterns differed. The findings matter because they show that LLM-based evaluation can be manipulated with simple prompts, which calls for more robust evaluation systems.
Key points
- The benchmark has 142 questions covering the 6 levels of the revised Bloom's Taxonomy, with data generated by gpt-4-0613. The data is released at GitHub (FreedomIntelligence/Humans_LLMs_Judgement_Bias).
- Human judges were college students. They showed almost no Gender Bias but clear Misinformation Oversight Bias and Beauty Bias.
- Among LLM judges, GPT-4o and Claude-3 were best at spotting factual errors and gender bias, while Claude-2 was weakest on factual errors. Under combined Ref+RC perturbation, Ernie and LLaMA2-70B scored below random on gender-biased content.
- A zero-shot prompt-based attack using fake references and rich content reached up to 50% ASR on GPT-4. Fake references alone deceived judges more than rich formatting did.
- Fake references most easily flipped verdicts when the two original answers were close in quality. Judges stayed fairly robust when the quality gap was large.
