Agent-as-a-Judge: Evaluate Agents with Agents
Paper · 2024 · Mingchen Zhuge, Changsheng Zhao, Dylan Ashley et al.
Summary
Agentic systems solve problems through long sequences of actions, but most benchmarks only score the final output. This misses where things go wrong, and detailed human review is too slow and expensive. Zhuge et al. (Meta AI and KAUST) propose Agent-as-a-Judge, which extends LLM-as-a-Judge: the evaluator is itself an agent that can inspect a workspace, gather relevant context and check requirements step by step. To test the idea on code generation, they built DevAI, a benchmark of realistic AI-app development tasks with hierarchical requirements and preferences. They ran three open-source coding frameworks (MetaGPT, GPT-Pilot, OpenHands) on DevAI. Each run was scored by three human experts, by LLM-as-a-Judge and by the new agentic judge. Agent-as-a-Judge agreed with the human consensus much more often than LLM-as-a-Judge did, and it matched that consensus better than individual human evaluators did. It also cost a small fraction of the human effort. This makes it a plausible scalable source of intermediate reward signals for training and improving agents.
Key points
- DevAI contains 55 AI development tasks with 365 hierarchical user requirements, plus tags and preferences. It is published on Hugging Face (
devai-benchmark), and the code is at GitHubmetauto-ai/agent-as-a-judge. - Human judges found that GPT-Pilot and OpenHands each met roughly 29% of requirements, but only one task was fully completed.
- Agent-as-a-Judge agreed with the human consensus about 90% of the time, compared with about 70% for LLM-as-a-Judge.
- Cost: the human evaluation took 86.5 hours (about 1297.50 USD), while Agent-as-a-Judge took 118.43 minutes and 30.58 USD. That is roughly 2.3% of the human time and cost.
- The authors suggest the judge's intermediate feedback could support process-supervised reward models and self-improving "flywheel" setups for agents.
