Autonomous Evaluation and Refinement of Digital Agents

Summary
Digital agents for web browsing and phone control still fail at simple tasks. Judging their behaviour usually requires hand-written success checks or human demonstrations, which rarely exist outside curated benchmarks. The authors propose general-purpose neural evaluators that read a user instruction, the agent's text actions and the resulting screenshots, then decide whether the task succeeded. Evaluation can be done once per trajectory or step by step. They test two designs. The end-to-end design prompts GPT-4V directly. The modular design first uses a VLM captioner to describe each screenshot and then has a text-only LM reason over those descriptions. For the captioner, they fine-tune an open-weight VLM on screenshot descriptions drafted by GPT-4V and corrected by hand. On WebArena and Android-in-the-Wild, the evaluators agree with oracle metrics 74.4–92.9% of the time. The judgments also improve agents with no extra supervision. Used as the reward in Reflexion, they help the strongest GPT-4 WebArena agent. Used to filter trajectories for behavior cloning, they help on Android and iOS. This makes it possible to assess and refine agents in real settings that lack ground-truth checks.
Key points
- Agreement with oracle evaluation reaches up to 82.1% on WebArena and 92.9% on Android-in-the-Wild (AitW).
- Using the evaluator as the reward function in Reflexion raises the best GPT-4 WebArena agent's success rate by up to 29% in relative terms.
- On Android, the AutoUI-base policy was trained on 560 tasks and tested on 96.
- The base policy solved 15 tasks.
- Self-training raised this to 18.9 ± 1.0.
- Filtered BC with the step-wise evaluator reached 26.0 ± 0.8, a 73% relative gain.
- On iOS, which has no existing benchmark or training data, a CogAgent policy improved from 8 to 14 solved tasks out of 52 with filtered BC (11 with self-training).
- In a manual error analysis, faulty reasoning was the most common failure: about 50% of errors for the GPT-4V/GPT-4 evaluators and 70% for Mixtral-Captioner. Code and data are released at github.com/Berkeley-NLP/Agent-Eval-Refine.
