Nudging: Inference-time Alignment of LLMs via Guided Decoding

Paper · 2025 · Yu Fei, Yasaman Razeghi and Sameer Singh

Summary

Aligning every size of an LLM family through instruction tuning or RLHF is expensive. Earlier analyses suggest alignment mostly changes a small set of stylistic tokens. The authors build on this with NUDGING, a decoding procedure that requires no training.

They first show, on GSM8K, MMLU and just-eval-instruct, that base models are noticeably unsure at exactly the positions where they would diverge from their aligned counterparts. They also find that small and large aligned models of the same family tend to choose similar tokens at those spots.

In NUDGING, a large base model writes the answer. Whenever its top-1 probability falls below a threshold, a much smaller aligned model supplies the next word. The method was tested on Llama-2, Gemma-2 and OLMo across 13 benchmarks. Pairing a base model with a 7–14× smaller aligned helper roughly matches the zero-shot quality of the large aligned model, and sometimes beats it. This holds even when the two models come from different families.

The result points to a cheap, modular way of aligning newly released base models without retraining them.

Key points

  • Where to nudge: a certainty threshold of 0.5 on the base model's top-1 probability catches over 80% of alignment-related positions. Only about 11% of all positions fall below it.
  • Same-family results: OLMo-7b guided by OLMo-1b-instruct averages 40.8, versus 39.2 for OLMo-7b-instruct. On LastLetterConcat, Gemma-2-27b plus Gemma-2b-it reaches 86%, against 6.7% and 4.7% for each model alone and 82% for Gemma-2-27b-it.
  • Cross-family results: Gemma-2-27b nudged by Llama-2-7b-chat beats Llama-2-70b-chat on several tasks. Nudging operates on whole words, which lets models with different tokenizers cooperate.
  • Efficiency: roughly 10% of output tokens come from the helper model. The method runs about 20× faster than earlier inference-time tuning approaches, and prefix caching keeps overhead to around 15% over the base model alone.
  • Limitations: experiments cover English datasets only and focus on instruction following. Broader alignment concerns such as bias, hallucination and misuse with harmful small models remain open.
