Thinking in Space: How Multimodal Large Language Models See, Remember, and Recall Spaces

Paper · 2024 · Jihan Yang, Shusheng Yang, Anjali W. Gupta et al.

Summary

The paper asks whether multimodal LLMs trained on large video collections can form an internal picture of a physical space from a walkthrough recording and later answer questions about it. To test this, the authors built VSI-Bench, with more than 5,000 question-answer pairs over 288 real indoor videos. The videos come from the validation splits of ScanNet, ScanNet++ and ARKitScenes. Most questions are produced from templates using the source datasets' 3D object annotations, while route-planning items were written by people. All items were reviewed to remove ambiguity and annotation errors. Both open and proprietary models show some emerging spatial competence but remain well below human level. To find where models fail, the authors had them explain answers in text and sketch "cognitive maps" of object locations. The main weakness is spatial reasoning, not perception, language or temporal memory. Models place nearby objects well but lack a coherent global layout. Common prompting tricks bring no gain, whereas drawing a map first improves distance questions. This gives a testbed relevant to robotics, AR/VR and embodied agents.

Key points

  • VSI-Bench: more than 5,000 QA pairs from 288 egocentric indoor videos (ScanNet, ScanNet++, ARKitScenes) covering homes, offices, labs and factories. It has eight tasks in three groups:
    • configurational: counting objects, judging how far apart objects are and which direction one lies from another, and planning routes;
    • measurement estimation: object size, room size, absolute distance;
    • spatiotemporal: appearance order.
  • Main bottleneck: analysis of self-explanations points to spatial reasoning, especially egocentric-allocentric transformation and relational reasoning, as the main cause of errors.
  • Local vs. global maps: in its cognitive maps, the MLLM positions adjacent objects correctly about 64% of the time. Accuracy drops sharply as the distance between objects grows, suggesting local rather than unified world models.
  • Prompting techniques: chain-of-thought, self-consistency and tree-of-thoughts do not raise benchmark scores.
  • Map-first prompting: having Gemini-1.5 Pro generate a cognitive map before answering raises relative-distance accuracy from 46.0 to 56.0. A ground-truth map gives 66.0 on a 10×10 grid and 78.0 on a 20×20 grid.
