Evaluating Retrieval Quality in Retrieval-Augmented Generation
Paper · 2024 · Alireza Salemi and Hamed Zamani
Summary
Retrieval components in RAG systems are hard to assess. Full end-to-end evaluation costs a lot of compute and gives only one score per result list. Classic relevance judgments, such as KILT provenance labels, turn out to track downstream RAG quality poorly. Salemi and Zamani propose eRAG, which uses the RAG system's own LLM as the judge. The LLM receives the query with one retrieved document at a time. Its output is scored against the task's gold answer with the task metric (EM, accuracy or F1), and that score becomes the document's relevance label. Standard retrieval metrics such as MAP, MRR, NDCG, precision, recall and Hit Ratio then aggregate these labels per list. Experiments cover five KILT datasets with a T5-small Fusion-in-Decoder reader. eRAG correlates with end-to-end performance noticeably better than answer-matching, provenance or Mistral-based judgments. It is also faster and far lighter on GPU memory. The method gives a cheap, document-level signal suited to tuning retrievers for the LLM they feed, and the code is public.
Key points
- Data and setup: NQ, TriviaQA, HotpotQA, FEVER and Wizard of Wikipedia (WoW), all from KILT, were evaluated on their validation sets.
- The corpus was the KILT Wikipedia dump, split into passages of up to 100 words.
- Retrieval used BM25 (Pyserini) and Contriever (Faiss).
- Correlation gains: Kendall's τ with downstream performance improved by 0.168 to 0.494 in absolute terms over the baselines.
- Correlation dropped as more documents were retrieved.
- It stayed stable across T5-small and T5-base.
- It was slightly higher with FiD than with In-Prompt Augmentation.
- Speed: eRAG ran about 2.47× faster on average than end-to-end evaluation, ranging from 1.23× (WoW) to 3.25×.
- Memory: eRAG needed roughly 7 to 15 times less GPU memory at query level and up to about 50 times less at document level.
- Example: 75 GB versus 1.5 GB on NQ.
- Code: The implementation is released at github.com/alirezasalemi7/eRAG.
