InnovatorBench: Evaluating Agents' Ability to Conduct Innovative LLM Research

Paper · 2025 · Yunze Wu, Dayuan Fu, Weiye Si et al.

Summary

Most benchmarks for AI research agents test isolated skills, such as reproducing published results or fixing code, in small sandboxes with short time limits. InnovatorBench asks a harder question: can an agent carry out a full LLM research cycle, from devising a method through implementation and training to evaluating and resubmitting results? The authors built 20 tasks based on papers from venues such as NeurIPS and ICLR. Of the six areas the tasks span, three deal with data (how it is constructed, filtered and augmented), two deal with training signals (designing losses and designing rewards), and the last involves building scaffolds. Each task comes with hidden reference solutions and scoring scripts that measure correctness, output quality and sometimes prediction uncertainty. Agents operate inside ResearchGym, a companion platform that supports long multi-machine GPU jobs, asynchronous execution, web access and snapshot save/restore. A lightweight ReAct agent driven by frontier LLMs handled code-heavy work fairly well. It struggled, however, with brittle algorithm design and long-horizon decisions. The work matters because it measures sustained, resource-aware innovation rather than replication.

Key points

  • InnovatorBench contains 20 tasks across 6 domains (DC, DF, DA, LD, RD, SC). Task time horizons range from 2 to 36 hours, and agents may submit multiple times.
  • ResearchGym provides terminal and file operations, web search and browsing, and multi-computer control. It also supports distributed training, asynchronous monitoring and snapshot saving/loading. It is designed as an extensible platform to which the community can add new tasks.
  • The evaluated backbones were Claude Sonnet 4, GPT-5, GLM-4.5 and Kimi-K2, all run within a ReAct-style agent.
  • The authors identify four recurring failure modes:
    • impatience, such as killing long training runs early;
    • GPU resource contention;
    • choosing Transformers over the faster vLLM for inference;
    • templated, semantically empty CoT generation.
  • Agents need over 11 hours to reach peak performance on InnovatorBench, compared with about 1.75 hours on PaperBench. This makes InnovatorBench roughly 6.5× longer to saturation.
