KL for a KL: On-Policy Distillation with Control Variate Baseline
Paper · 2026 · Minjae Oh, Sangjun Song, Gyubin Choi et al.
Summary
On-Policy Distillation (OPD) trains a student LLM on its own sampled outputs and pulls it toward a teacher by minimizing reverse KL. It has become a common post-training step for reasoning models. However, its standard single-sample Monte Carlo gradient is noisy, which makes training unstable. Existing fixes have drawbacks: computing the KL over the whole vocabulary is expensive, and truncating it to top-k tokens biases the objective.
The authors treat OPD as policy-gradient RL with a per-token reward and apply the classic RL remedy of subtracting a baseline. They show that the value function has a closed form: the negative per-token reverse KL between student and teacher. This quantity comes directly from logits already computed in the forward pass. Because it is used without gradient, the estimator stays unbiased, and the backward pass still involves only the sampled token. A cheaper top-k version of the baseline also keeps the gradient unbiased.
On Qwen3 and Olmo-3 students across math and science benchmarks, vOPD outperforms vanilla and top-k OPD and matches full-vocabulary OPD at lower cost.
Key points
- Evaluation covers four student models from the Qwen3 and Olmo-3 families on six benchmarks: MATH500, Minerva Math, AMC23, AIME24/25, SciKnowEval and GPQA-Diamond.
- Compared with base OPD, vOPD improves average accuracy by up to about +3 points, with up to +6.2 on MATH500.
- vOPD matches full-vocabulary OPD while cutting per-step wall-clock time by up to 57.7% (measured on one NVIDIA H200). vOPD top-k gives the best accuracy-to-compute balance.
- During training, gradient norms under vOPD stay one to two orders of magnitude below those of base OPD.
- On science tasks, vOPD top-k scores 33.2 on SciKnowEval and 28.6 on GPQA-D, versus 29.3 and 24.7 for OPD. Experiments are limited to models of at most 7B parameters. Code is available at github.com/holi-lab/vOPD.
