LazyEviction: Lagged KV Eviction with Attention Pattern Observation for Efficient Long Reasoning
Paper · 2026 · Haoyue Zhang, Hualei Zhang, Xiaosong Ma et al.
Summary
Chain-of-Thought reasoning in LLMs can produce outputs of thousands of tokens, and the KV cache grows with every one of them. Existing compression methods evict tokens greedily at each decoding step, using either current or accumulated attention scores. The authors show that this fails on reasoning tasks because of a pattern they call Token Importance Recurrence (TIR): many tokens lose attention for a while and then become important again. These tokens often hold conditions or intermediate conclusions that later reasoning steps rely on. Their method, LazyEviction, evicts only once every W decoding steps, using an observation window. For each token it records the Maximum Recurrence Interval (MRI), the longest observed gap between attention spikes. It removes a token only after the time since its last spike (ΔT) exceeds that MRI. On reasoning models from 4B to 32B, it cuts the KV cache by 50–70% with accuracy close to, or above, FullKV. It also beats H2O, TOVA, RaaS and similar baselines. This makes long reasoning cheaper in memory without shortening the reasoning chains.
Key points
- Recurrence is the norm, not the exception: over 95% of tokens in multi-step reasoning show recurrent attention.
- Baselines break down on reasoning: at a 50% compression ratio, H2O and TOVA lose about 20% on GSM8K, although they hold up on PG-19 language modeling.
- Eviction policy: tokens are ranked by an MRI-centric importance score. Removing its H1 component causes a large accuracy drop, and removing H2 a smaller one.
- Window size W: W is set from offline MRI statistics on 1% of samples. As alternatives, the authors propose a calibration set or an online warm-up.
- Limitations and resources: on C4, MRI values are small (under 10), so the method gains little outside reasoning tasks. Models above 32B were not tested. Code is available at github.com/Halo-949/LazyEviction.
