The Art of Scaling Reinforcement Learning Compute for LLMs
Paper · 2025 · Devvrit Khatri, Lovish Madaan, Rishabh Tiwari et al.
Summary
Reinforcement learning now consumes a large share of LLM training compute. Unlike pre-training, though, it has no dependable way to forecast how a training recipe will behave as budgets grow. The authors tackle this with a study totalling over 400,000 GPU-hours on Nvidia GB200 hardware. Most runs use an 8B dense model trained on math reasoning with the Polaris-53K dataset. They model validation pass rate as a saturating sigmoid in compute. Its parameters separate the performance ceiling (A) from compute efficiency (B, C_mid), so fits from early training can be used to compare design choices.
The ablations show three things:
- Ceilings genuinely differ between recipes.
- Many popular tweaks mostly change efficiency rather than the ceiling.
- Methods that win at small budgets can fall behind at scale.
Combining the best existing components yields ScaleRL. A curve fitted on the first part of a 100,000 GPU-hour run accurately predicted the remainder. This matters because teams with modest compute can judge RL methods without running them to completion.
Key points
-
Fitted curve: R_C − R_0 = (A − R_0) / (1 + (C_mid/C)^B), fitted on held-out in-distribution validation data. Fits start after roughly 1.5k GPU-hours and proved more stable than power-law fits.
-
ScaleRL components: The recipe combines:
- asynchronous PipelineRL
- CISPO loss
- prompt-level loss averaging
- batch-level advantage normalization
- FP32 logits
- zero-variance filtering
- No-Positive-Resampling
- forced length interruptions
The off-policy algorithm, loss and precision had the largest effects.
-
Comparison with other recipes: ScaleRL reaches an asymptote of A = 0.61. This exceeds the GRPO (DeepSeek), DAPO (Qwen-2.5), Magistral and MiniMax-M1 recipes.
-
Large runs:
- The 8B model was trained for 7,400 steps and 100k GPU-hours, with the fit made on data up to 50k GPU-hours.
- The Llama-4 17B×16 MoE (Scout) was trained for 50k GPU-hours.
- Predictability held with 2.5× larger batches, 32,768-token generations and joint math+code training.
- Gains carried over to AIME-24.
-
Code release: Curve-fitting code is published at www.devvrit.com/scalerl_curve_fitting.
