Part I: Tricks or Traps? A Deep Dive into RL for LLM Reasoning
Paper · 2025 · Zihe Liu, Jiashun Liu, Yancheng He et al.
Summary
RL for LLM reasoning has accumulated many optimization tricks, and papers often disagree about them. Examples include group-level vs. batch-level reward normalization (GRPO vs. REINFORCE++), keeping or dropping the standard deviation term (Dr. GRPO), and sequence-level vs. token-level loss aggregation (GRPO vs. DAPO). The authors attribute much of this conflict to differing data, initial models and experimental setups.
To separate the effects, they re-implemented popular techniques in one open-source framework (ROLL) and tested each in isolation. The techniques cover normalization, clipping, filtering, and loss granularity. All runs used Qwen3 models of different sizes, both base and aligned, on math datasets of varying difficulty.
The main finding is that most tricks help only under certain conditions. Model type, data difficulty, reward design and hyperparameters all affect whether a trick pays off. From these results the authors derive practical selection guidelines. They also propose Lite PPO, a critic-free vanilla PPO loss with just two additions, which beats GRPO and DAPO on non-aligned models. This suggests that heavily engineered RL pipelines are often unnecessary.
Key points
- Lite PPO combines two techniques:
- advantage normalization that uses the group-level mean together with the batch-level standard deviation;
- token-level loss aggregation.
- Lite PPO was evaluated on Qwen3 4B-Base and 8B-Base models across six math benchmarks, including Minerva Math, AIME24 and AIME25. It trained stably, while GRPO and DAPO tended to collapse after peaking.
- Normalization: group-level normalization was robust across reward settings, while batch-level normalization was steadier when rewards were large in scale.
- Clipping: Clip Higher encouraged useful exploration mainly in aligned models. On small models, performance appeared to scale with the upper clipping bound.
- Loss aggregation and filtering:
- token-level aggregation helped base models but did little for aligned ones;
- overlong filtering improved short-to-medium reasoning but limited long-tail outputs.
