Self-Distilled Policy Gradient

Paper · 2026 · Yifeng Liu, Shiyuan Zhang, Yifan Zhang et al.

Summary

RLVR methods such as GRPO give a language model a single correctness score per sequence, so individual reasoning steps receive no specific credit. On-policy self-distillation offers dense token-level guidance instead: the same model sees privileged context, such as a reference solution, and acts as its own teacher. Without a verifier, though, it may reinforce plausible tokens on wrong trajectories.

The authors show that, on a fixed sampled prefix, the student-side gradient of a full-vocabulary reverse KL toward a detached privileged teacher is equivalent to a policy-gradient step. In that step, each token's advantage is a centered teacher/student log ratio.

Building on this, SDPG combines three parts:

  • group-normalized verifier advantages,
  • exact full-vocabulary self-distillation,
  • an unnormalized KL anchor to a fixed reference policy.

Distillation applies only to positive-advantage rollouts, and its weight follows a warmup-decay schedule. With Qwen3-4B, SDPG outperforms GRPO and RLSD on AIME and AMC benchmarks. This suggests that dense self-supervision and verifier rewards complement each other.

Key points

  • SDPG has two reference-KL variants, SDPG-URKL (unnormalized reverse) and SDPG-UFKL (unnormalized forward), building on the RPG framework.

  • Privileged context for the teacher includes dataset answers plus solutions generated by Gemini 2.5 Pro.

  • Setup: Qwen3-4B, 400 training steps, evaluated with pass@1 (mean@32) on AIME24, AIME25 and AMC23.

  • Final-step scores (AIME24 / AIME25 / AMC23):

    MethodAIME24AIME25AMC23
    GRPO0.2800.2420.714
    RLSD0.3780.3000.813
    SDPG-URKL0.3800.3070.863
    SDPG-UFKL0.3800.3270.858

    The best peaks came from SDPG-UFKL: 0.408 / 0.335 / 0.870.
