Summary
RLHF for LLMs runs several large models (actor, critic, reference policy, reward model). Each needs its own distributed training or generation setup, and every step moves data between models that are parallelized in different ways. Classic RL frameworks such as RLLib use one central controller, which adds heavy dispatch overhead at LLM scale. Current RLHF systems instead give every device its own controller. This tangles model code with communication logic, so changing the algorithm means editing many components. HybridFlow divides the work. A single controller coordinates the dataflow between models, while each model runs internally in multi-controller fashion on existing backends (3D parallelism, ZeRO, PyTorch FSDP). Hierarchical APIs and transfer protocols hide data resharding, so an RLHF algorithm fits in a short single-process script. A 3D-HybridEngine switches the actor between training and generation layouts without duplicating memory. A mapping algorithm chooses GPU allocation and model placement. Against state-of-the-art RLHF systems, throughput improves 1.53× to 20.57×. This makes RLHF experimentation both easier to program and cheaper to run.
Key points
- Hybrid design: inter-model orchestration is single-controller, while intra-model computation stays multi-controller for efficiency.
- The 3D-HybridEngine reshards actor weights between training and generation with zero memory redundancy and much less communication.
- An automatic mapping algorithm selects GPU allocation and colocation of models for any RLHF dataflow.
- It supports diverse algorithms (e.g., PPO, Safe-RLHF, ReMax). Non-neural reward modules such as code sandboxes or math checkers can also be wrapped in.
- The paper appeared at EuroSys ’25, and the code is open-sourced as verl (github.com/volcengine/verl).
