Summary
Reinforcement Learning with Verifiable Rewards (RLVR) is now a standard way to improve LLM reasoning. However, it is unclear which generated tokens are responsible for the gains. The authors study this question through token entropy in Chain-of-Thought outputs. They find that most tokens are produced with low uncertainty and simply continue the current phrase. A small share of high-entropy "forking" tokens instead determine which direction the reasoning takes. Raising the entropy of these forks during decoding improves accuracy, and lowering it hurts. Tracking entropy through RLVR training shows that the trained model largely keeps the base model's entropy profile, changing mostly the already uncertain positions. Based on this, the authors modify a DAPO baseline so that policy gradients flow only through the top 20% highest-entropy tokens. On Qwen3 base models, this matches full-token training at 8B and clearly outperforms it at 14B and 32B. Training only on the low-entropy 80% sharply degrades results. The work offers a token-level account of why RLVR works and points toward more targeted training.
Key points
- Method: Gradients are retained solely for the most uncertain 20% of tokens, ranked by entropy, while the other 80% are masked out. It builds on DAPO and is tested on Qwen3-8B, Qwen3-14B and Qwen3-32B base models with math data.
- Gains over full-gradient RLVR:
- Qwen3-32B improves by +11.04 on AIME'25 and +7.71 on AIME'24.
- Qwen3-14B improves by +4.79 on AIME'25 and +5.21 on AIME'24.
- Qwen3-8B performs on par.
- The benefit grows with model size.
- State-of-the-art result: With a 20k maximum response length, the 32B model reaches 63.5 on AIME'24 and 56.7 on AIME'25. This is reported as SoTA for RLVR from base models under 600B parameters. Extending the length to 29k raises AIME'24 to 68.1.
- Ablations: Using 10%, 50% or 100% of tokens performs worse than about 20%. The authors attribute this to reduced exploration in those settings.
- Limitations and venue: Experiments cover only Qwen models (LLaMA models failed to reach meaningful AIME scores) and only mathematics. The paper was accepted to NeurIPS 2025 (arXiv:2506.01939).
