Doc-V*: Coarse-to-Fine Interactive Visual Reasoning for Multi-Page Document VQA

Paper · 2026 · Yuanlei Zheng, Pei Fu, Hang Li et al.

Summary

The paper addresses question answering over long, visually dense multi-page documents without OCR. Existing approaches have clear weaknesses. End-to-end multimodal models handle long documents poorly as page counts grow. Visual RAG pipelines depend on a fixed top-k retrieval step and cannot adjust once reading begins. The authors propose Doc-V*, an agent built on Qwen2.5-VL that treats the task as step-by-step evidence collection. It first sees low-resolution thumbnail grids of the whole document to learn its structure. It can then run semantic page retrieval, request specific pages at high resolution, or answer, and it records findings in a structured working memory. Training has two stages. Supervised fine-tuning uses GPT-4o-synthesized interaction trajectories. GRPO then adds rewards for answer quality, evidence discovery and output format. On five benchmarks, Doc-V* beats open-source baselines and comes close to proprietary systems such as GPT-4o. Its largest gains are out of domain, up to 47.9% over a RAG baseline. The work suggests that long-document understanding depends more on selective evidence gathering than on feeding the model more pages.

Key points

  • Action space: retrieval_page sends a free-text query to an external retriever (e.g., ColQwen) and returns the top-k unvisited pages. fetch_page returns pages by absolute index. A third action produces the final answer.
  • Inputs: Thumbnails are 256×256 and labeled with page numbers. Full pages are capped at 1024×768, and their visual tokens are pre-cached and supplied only on request.
  • Results on MMLongBench-Doc: The full model reaches 39.8 accuracy, using about 6.4 pages on average.
    • Without the thumbnail overview, accuracy is 34.9.
    • Without page-by-page analysis, it is 35.9.
    • Without memory, it is 36.4.
    • Without retrieval, accuracy is 34.9 and page use rises to about 14.2.
    • Without fetch, accuracy is 35.2.
  • Other benchmarks: The full model scores 53.0 accuracy on LongDocURL and 73.8 F1 on SlideVQA.
  • Robustness: Performance degrades only moderately with weak text retrievers such as BM25 and BGE-Large, because the agent can fetch pages the retriever missed. Stated limitations are that only one backbone was tested and only single-document settings were evaluated.
